The extent of contamination was quantified using multiple pollution indices, including the geo-accumulation index (Igeo) and enrichment factor. Health risks were evaluated using both deterministic and probabilistic approaches, incorporating Monte Carlo simulation to characterize uncertainty and Sobol sensitivity analysis to identify key influencing parameters. Mean heavy metal(loid) concentrations (mg kg −1 ) decreased in the order of Fe (28,136) > Zn (480.73) > Cr (184.85) > Pb (147.12) > Ni (73.5) > Cu (55.50) > As (15.97) > Cd (5.27). Pollution indices consistently identified Cadmium (Cd) and Lead (Pb) as the primary contributors to soil contamination. Enrichment factor analysis revealed extreme enrichment for Cd, with concentrations exceeding background levels by up to 58 times. Probabilistic risk assessment indicated a high potential for adverse health effects. For children, the non-carcinogenic Hazard Index for lead exceeded the safe limit of 1 in over 50% of simulations. The Total Carcinogenic Risk (TCR) for children surpassed the acceptable threshold (1 × 10 −4 ) in over 80% of simulations for As, Cr, and Cd. For adults, the TCR for Cd exceeded this threshold in over 70% of cases. The 95th percentile of the simulated TCR for children reached 5.7 × 10 −3 , a value 57 times higher than the acceptable limit. Sobol analysis identified the soil ingestion rate as the primary source of uncertainty in the risk models (contributing 68–74%). These findings indicate that the soil contamination poses a significant health risk to the local population, warranting targeted intervention strategies. This study elucidates salinity sources and quantifies inter-aquifer mixing dynamics using an integrated approach combining self-organizing map (SOM) analysis, NETPATH inverse modeling, multiple isotopic tracers (δ 1 ⁸O, δ 2 H, ⁸⁷Sr/⁸⁶Sr, 13 C, 14 C), and 3D numerical modeling with reverse particle tracking. Analysis of 153 water samples revealed three distinct hydrochemical groups: High salinity TCA waters influenced by evaporation and recharge from salt lakes, intermediate salinity mixing zones, and low-salinity NSSA paleowaters aged 4,300–14,200 years. Salt lake contributions to TCA groundwater salinity range from 0.6–18%, while fault-controlled NSSA discharge contributes 52–90% to TCA recharge. Predictive modeling indicates the non-renewable groundwaters in the NSSA will experience 30–40 m of drawdown by 2100 under current groundwater abstraction rates, exacerbating TCA salinization. These findings provide a framework for sustainable groundwater management in complex arid aquifer systems and highlight the urgent need for protection of fault-controlled recharge zones. This study presents a comprehensive assessment of groundwater quality in the Gonbad Plain, Iran, to determine its suitability for drinking and to identify the controlling hydrogeochemical processes. A total of 45 groundwater samples were analyzed for their physicochemical parameters, and the data were evaluated using an integrated approach combining hydrochemical facies analysis, geochemical modeling (PHREEQC), multivariate statistical techniques (Principal component analysis (PCA) and hierarchal cluster analysis (HCA)), and human health risk assessment (Heavy metal pollution index (HPI), Hazard quotient (HQ), Hazard index (HI)). The results reveal a hydrochemical evolution from fresh Ca-HCO₃ type water to saline Na-Cl type water, primarily controlled by three key mechanisms: (1) dissolution of evaporite minerals (halite and gypsum), (2) cation exchange, and (3) evaporation. The Gibbs diagrams confirmed that rock-water interaction and evaporation are the dominant processes governing water chemistry. Iron concentrations varied from 0.01 mg/L to 4.12 mg/L, with a mean of 0.46 mg/L and a standard deviation of 0.66 mg/L. The median iron concentration was 0.27 mg/L. Manganese concentrations ranged from 0.015 mg/L to 0.47 mg/L, with a mean of 0.09 mg/L and a standard deviation of 0.07 mg/L. The median manganese concentration was 0.08 mg/L. The HPI indicated a critical water quality crisis, with 77.8% of the samples being unsuitable for drinking (HPI > 100), primarily due to elevated concentrations of manganese. The non-carcinogenic health risk assessment revealed that while the dermal exposure pathway poses no significant risk, oral ingestion of groundwater presents a potential health hazard, particularly for children. The HI exceeded the safe limit of 1.0 in 11.1% of the samples for children, with manganese being the primary contributor to the risk. This is the first study apply integrated framework that combines multivariate statistics, geochemical modeling, and health risk indices to evaluate groundwater vulnerability in Gonbad-e Kavus. The study’s alignment with UN Sustainable Development Goal 6 (Clean Water and Sanitation). Understanding the dynamic interplay between rainfall, river discharge, and groundwater levels remains challenging due to the complexity of hydrogeological structures and variable recharge conditions. This study investigates the temporal relationships among rainfall, river stage-discharge, and groundwater levels in the Erbil Basin, North Iraq. A multivariate time series framework was employed for the data series spanning 2004–2022, combining wavelet coherence analysis to identify dominant periodicities and temporal correlations, with a vector autoregression (VAR) model to forecast future groundwater fluctuations. The wavelet analysis revealed strong monthly-scale variability during the wet season and a pronounced rainfall-groundwater coherence with a dominant 1-month periodicity, particularly after 2008. Spatial differences in coherence strength across monitoring wells indicate regionally consistent hydrogeological conditions, with stronger coupling observed in wells situated closer to the Lesser Zab River. The impulse response function (IRF) analysis additionally demonstrated positive groundwater responses within 2–6 months following rainfall events, consistent with regional recharge patterns. However, persistent groundwater declines identified in the VAR forecasting model reflect the combined effects of reduced recharge and continuous abstraction pressures. The integrated approach provides a comprehensive assessment of hydroclimatic interactions and groundwater dynamics in the Erbil regional aquifer. The findings emphasize the need for adaptive groundwater management strategies and demonstrate the potential of combining wavelet and VAR models for sustainable water resource planning in data-limited, semi-arid environments. This study investigates the spatiotemporal evolution of groundwater chemistry in the Debrecen area, Hungary, from 2019 to 2024, using indexing, machine learning, and multivariate statistical techniques. These techniques include self-organizing maps (SOM), hierarchical cluster analysis (HCA), principal component analysis (PCA), and groundwater quality indexing (GWQI). The hydrochemical analysis revealed that Ca-Mg-HCO₃ is the dominant water type, with a temporal shift toward Na-HCO₃, reflecting increased salinity driven by ongoing rock-water interactions. SOM analysis showed a transition from heterogeneous to more uniform groundwater chemistry over time, suggesting greater stability in the aquifer system. Elevated salinity zones shifted spatially due to changes in groundwater recharge and flow patterns, while hardness intensified and expanded, indicating continued carbonate dissolution. HCA highlighted temporal shifts in groundwater composition, with six clusters identified in 2019 and five clusters in 2024, reflecting a gradual homogenization of water quality. PCA further confirmed this trend, linking it to underlying hydrochemical processes, such as water–rock interactions, with limited contributions from anthropogenic influences. The GWQI analysis indicated a general improvement in groundwater quality over time, with most regions meeting drinking water standards. However, specific areas exhibited signs of localized contamination, requiring targeted management. These findings underscore the importance of continuous groundwater quality monitoring to detect emerging trends and guide resource management. The study highlights the need for sustainable practices to safeguard water resources and ensure long-term water security in the Debrecen area. This study investigates how groundwater quality has evolved over time and its implications for sustainable irrigation. The research integrates hydrochemical assessment with machine learning to enhance the spatiotemporal evaluation of irrigation water quality. Groundwater samples from the Debrecen area (2019–2024) were analyzed using Hierarchical Cluster Analysis (HCA), irrigation indices (SAR, Na%, IWQI), and Self-Organizing Maps (SOMs) to understand spatial and temporal patterns. A Convolutional Neural Network (CNN) model was developed to predict IWQI from key water quality parameters, aiming to reduce manual calculation errors. HCA indicated low to moderate mineralization in most samples, while SOMs revealed notable spatial and temporal shifts, including gradual degradation due to natural and anthropogenic factors. IWQI assessments confirmed general suitability for irrigation, although localized risks due to salinity and sodium hazards were identified. The CNN model achieved high predictive accuracy (R² >0.97), streamlining IWQI estimation and minimizing human error. The findings highlight the utility of machine learning in groundwater quality monitoring and support more sustainable, adaptive irrigation practices to protect long-term soil productivity and food security. The methods used included principal component and cluster (dendrogram) analysis to estimate source of ions and contamination. Various indices such as the Heavy Metal Pollution Index (HPI), Metal Index, hazard quotient, hazard index (HI), and cancer risk (CR) were applied to assess both environmental and human health risks. Furthermore, the Monte Carlo method was applied for probabilistic assessment of carcinogenic and non-carcinogenic risks through oral and dermal exposure routes in both adults and children. The results revealed that approximately 16% of the samples fell within the low pollution category (HPI < 100), indicating relatively lower levels of heavy metal contamination. However, the remaining 84% of the samples exhibited high pollution levels, indicating a significant presence of heavy metal pollutants in the northeastern part of the investigated area. The calculated average risk index (RI) for the collected samples was 18.99, with a range from 0.03 to 103.21. This indicates that a large portion, 82% of the samples, could cause low ecological risk (RI < 30), whereas the remaining 18% indicate a significant environmental pollution risk. The HI for oral ingestion showed that adults had HI values ranging from 0.231 to 1.54, while children exhibited higher values, ranging from 0.884 to 5.9 (Fig. 5a). For dermal exposure, HI values in adults ranged from 2.71E−07 to 8.74E−06 and in children, from 2.18E−06 to 7.03E−05. These findings highlight the potential non-carcinogenic risks associated with oral exposure to PTEs and underscore the increased vulnerability of children to metals such as Fe, Mn, Pb, and Cr. Most samples showed CR exceeding 1 × 10 −4 for chromium (Cr) and lead (Pb), indicating a significant vulnerability to carcinogenic effects in both children and adults. Accordingly, the sustainability of water resources in this arid environment should be examined in terms of the possibility of groundwater recharge, particularly through runoff water, while identifying the most appropriate potential sites for drilling new water wells to cover current and future needs. The aquifer system of El-Qaa Plain in South Sinai is considered one of the structural basins associated with the tectonic setting of the Gulf of Suez. It is the main source of high-quality water in South Sinai. The present work provided an integration of mathematical flow modeling, hydrochemical composition, environmental isotopic signature, watershed modeling system (WMS), and remote sensing (RS) tools to determine the aquifer sustainability and recharge mechanisms. The obtained results indicated the following: (a) the salinity of the water ranged between 326.4 and 2261 ppm, while the environmental isotope values ranged between −6.28 to −4.48‰ for δ18O and −29.87 to −21.7‰ for δ2H, which reveals the phase of recharge and mixing between ancient water and recent rainwater; (b) sites for three dams in three sub-watersheds were proposed to harvest approximately 790,000 m3/y of runoff water to enhance groundwater recharge of the aquifer system; (c) and five scenarios using MODFLOW indicated that water drawdown is acceptable by adding 10 new production wells (discharge rate increased by 3600 m3/day). Moreover, increasing the recharge rate by 2% from the base case, leads to an increase in the piezometric water level with an average value of 0.13 masl, which reflects the positive effects of the proposed runoff water harvesting facilities. The integration applied in this work represents an integrated management system for water resources (surface and groundwater) which is suitable for application in arid or semi-arid coastal and similar areas.
